Serving harness architecture now dictates enterprise AI production viability over model benchmarks
Enterprise AI production success now depends on serving harness engineering for memory, scheduling, and cost rather than model scale. Data from inference systems confirms KV cache and concurrency as primary limits. Investment shifts to workload-specific architecture yield higher utilization without added hardware.
The MIT Technology Review analysis identifies serving architecture as the binding constraint once models move from proof-of-concept to production. Workload-specific requirements for concurrency, batch scheduling, and cost per token now override marginal gains in benchmark accuracy. Organizations that optimized solely for model capability encounter memory pressure and unpredictable latency under real traffic patterns.
Evidence from deployed systems shows KV cache growth with context length and active requests creates the dominant bottleneck before compute capacity is exhausted. Systems adding GPUs without addressing memory management increase costs without resolving throughput limits. Techniques such as paged attention and dynamic batching only deliver value after the primary constraint is measured and mitigated.
Related work in vLLM's PagedAttention (USENIX 2023) and NVIDIA's TensorRT-LLM scheduler demonstrates that memory-aware serving yields 2-3x higher effective concurrency on identical hardware. This pattern repeats across internal knowledge bases and customer-facing assistants where overnight batch pipelines tolerate different tradeoffs than sub-100ms response services.
Operationally, teams must instrument memory and latency before applying quantization or speculative decoding. The next measurable milestone is production deployments achieving sustained 70% GPU utilization at target latency SLOs within 90 days of harness redesign.
vLLM maintainers: Production clusters using paged KV cache will sustain 2.5x higher concurrent requests at fixed latency by end of 2025.
